Equivariant Neural Belief Propagation

Problem

Method

The framework synthesizes rank-2 precision matrices through equivariant outer products, which are processed using differentiable spectral decomposition. To maintain computational tractability, a greedy KL-based mixture reduction is employed, ensuring that the reduction process commutes with SE(3) transformations. This architecture allows for the effective representation of uncertainty in multi-body systems and spatially embedded variables.

Results
ENBP demonstrates significant performance improvements on the GEOM-QM9 and GEOM-Drugs benchmarks, achieving 98.9% conformational coverage with a mean error of 0.090 Å. This performance is achieved with sub-second latency, making ENBP over 100 times faster than diffusion-based methods while maintaining higher accuracy. In the context of multi-body robotic inference, traditional loopy belief propagation (BP) methods diverge when applied to systems with 15 or more agents, whereas ENBP converges reliably, exhibiting near-zero collision rates and maintaining machine-precision equivariance error on the order of (10^{-7}), compared to (10^{-1}) for augmented baseline methods.

Limitations
The authors acknowledge that while ENBP significantly improves upon existing methods, it may still face challenges in scalability for extremely large systems or in scenarios with highly complex interactions that are not well-captured by the current GMM framework. Additionally, the reliance on the SE(3) symmetry may limit applicability in contexts where such symmetry does not hold. The paper does not discuss potential computational overhead associated with the mixture reduction process or the implications of the greedy approach on the quality of the resulting GMMs.
